Reinforcement Learning
Reinforcement Learning is a major branch of machine learning in which an agent learns an optimal decision-making policy through continuous interaction with an environment. At each state, the agent takes an action and adjusts its behavior based on reward or penalty signals from the environment, with the objective of maximizing long-term cumulative reward. It does not rely on labeled data, is applicable to sequential decision problems, and is widely used in game playing, robotics, autonomous driving, and resource scheduling.
Core Facts
Machine learning is typically divided into three major paradigms: supervised learning, unsupervised learning, and reinforcement learning.
DQN is an algorithm proposed by DeepMind in 2013 that for the first time combined deep neural networks with Q-learning reinforcement learning, enabling AI to learn to play 49 Atari games.
The pre-training process of large language models requires thousands of high-end GPUs running in parallel for months, with costs typically ranging from tens of millions to hundreds of millions of dollars.
Timeline (last 90 days)
Common suggestions in the community include: start by reproducing classic algorithms to build up a code portfolio, participate in fixing issues in small open-source projects on GitHub, or provide valuable discussion of specific technical problems in relevant forums.
RL projects require participants to understand theoretical frameworks such as Markov decision processes, value function approximation and policy optimization, and to be able to diagnose engineering problems such as training non-convergence and variance explosion.
In RL engineering practice, reward design often determines project success or failure more than model architecture.
The RL training process involves the exploration-exploitation tradeoff, the high variance of policy gradient estimation, and the risk of reward hacking caused by improperly designed reward functions.
In RL training, performance variance across random seeds can be extremely large, hyperparameters have a far stronger effect on results than in supervised learning, and debugging cycles are long with high compute consumption.
The collaboration barrier for reinforcement learning projects is relatively high, involving environment setup, reward design, training stability tuning and other steps, and it places demands on engineering ability and theoretical understanding.
Agents in RL must adjust their policies during interaction with the environment based on sparse or delayed reward signals, and there is no standard answer to fit directly.
When recruiting collaborators, mature RL project teams usually place more weight on whether candidates have demonstrable code repositories, papers they have reproduced or open-source contributions they have made.
A seemingly reasonable reward function may induce the agent to learn degenerate behaviors, for example repeatedly triggering a small reward in a game environment while giving up on completing the main task.
In continuous control, the goal of reinforcement learning is to learn a policy function π(a|s) that maps observations to actions, and to iteratively improve it by maximizing the cumulative discounted return.
